Two widely used decomposition methods for tensors are parallel factor analysis (PARAFAC), also known as canonical polyadic decomposition, and Tucker decomposition PARAFAC decomposes a given tensor into a sum of rank-1 tensors, while Tucker decomposition breaks down a tensor into a core tensor associated with a set of matrices (called factors) that are used to multiply along each mode, allowing for the modeling of a tensor along a particular dimension.

In the literature of tensors, various algorithms have been proposed for tensor decomposition These can be categorized into three main approaches: divide-and-conquer, compression, and optimization The first approach focuses on dividing a given tensor into a finite number of subtensors, estimating the factors of these subtensors, and then combining them into true factors The central idea of the second approach is to reduce the size of a given tensor until it becomes manageable before computing a specific decomposition of the compressed tensor, which retains the main information of the original tensor In the third approach, tensor decomposition is cast into optimization and solved using standard optimization tools For further details on the different approaches, we refer the reader to surveys in [10–12].

This thesis focuses on the divide-and-conquer approach for PARAFAC and high-order singular value decomposition (HOSVD) of three-way tensors HOSVD is a specific orthogonal form of Tucker decomposition Three-way tensors, represented as (image-row × image-column × time), are utilized in video surveillance, human action recognition, and real-time tracking Spatial tensors (spatial-row × spatial-column × wavelength) are applied for target detection and classification in hyperspectral image applications Temporal tensors (origin × destination × time) are used in transportation networks to discover the spatiotemporal traffic structure Additionally, time-frequency-electrode tensors are employed in EEG analysis Recently, generalized minimum noise subspace (GMNS) was proposed as an effective technique for subspace analysis, significantly reducing computational complexity while providing high estimation accuracy Several efficient algorithms for principal subspace analysis (PSA), minor subspace analysis (MSA), and PEAs utilizing GMNS have been proposed, demonstrating their applicability in various applications.

We propose two algorithms for PARAFAC and HOSVD based on GMPS These algorithms are highly beneficial and easy to implement in practice, thanks to their parallelized scheme with low computational complexity Several applications are studied to illustrate the effectiveness of the proposed algorithms.

The structure of the thesis is organized as follows: Chapter 2 provides background information for our study, including two types of algorithms for PSA and tensor decomposition Chapter 3 presents modified and randomized GMPS algorithms for PSA Chapter 4 discusses GMPS-based algorithms for PARAFAC and HOSVD Finally, Chapter 5 showcases experimental results, while Chapter 6 offers conclusions on the developed algorithms.

In this chapter, we provide a brief review of tensors and related mathematical operations in multilinear algebra, such as tensor additions and multiplications Additionally, we introduce a divide-and-conquer algorithm for PARAFAC known as alternating least-squares (ALS), which is fundamental to our proposed method Furthermore, it is important to first explain the central idea of the method before demonstrating how GMMs can be utilized for tensor decomposition.

Several divide-and-conquer based algorithms have been proposed for PARAFAC, focusing on the central idea of dividing a tensor \(X\) into \(k\) parallel sub-tensors \(X_i\) The process involves estimating the factors (loading matrices) of these sub-tensors and then combining them to obtain the factors of \(X\) In this section, we describe the algorithm proposed by Pugachev et al in [23], namely parallel ALS-based PARAFAC, summarized in Algorithm 1, which has motivated us to develop new algorithms in this thesis.

In this chapter, we introduce two modifications to the GMPS for PSA Specifically, by expressing the right singular vectors obtained from SVD in terms of principal subspace, we derive a modified GMPS algorithm for PSA that runs faster than the original GMPS while still retaining the subspace estimation accuracy Additionally, we present a randomized GMPS algorithm for PSA that can handle several matrices by performing the randomized SVD.
